Bayes' Theorem

Bayes’ Theorem is a way to update our beliefs when we see new evidence. It answers questions like: “Given that a test came back positive, what is the actual probability of having the disease?” It is one of the most important formulas in AI.

Bayes’ Theorem: P(A|B) = [P(B|A) × P(A)] / P(B). It tells you how to reverse conditional probabilities.

Understanding the Terms

  • P(A|B): Probability of A given that B happened (posterior).
  • P(B|A): Probability of B given A (likelihood).
  • P(A): Initial belief about A before seeing evidence (prior).
  • P(B): Total probability of evidence (normalizing constant).

Simple Example: Medical Test

A disease affects 1% of the population (P(Disease)=0.01). A test is 99% accurate: if you have the disease, it’s positive 99% of the time (P(Pos|Disease)=0.99). If you don’t have it, it’s positive only 5% of the time (false positive). You test positive. What is P(Disease|Pos)?

Using Bayes: P(Disease|Pos) = (0.99×0.01) / [0.99×0.01 + 0.05×0.99] ≈ 0.167.
Even with a positive test, only about 17% chance you actually have the disease – because the disease is rare and false positives are common.

Why Bayes Matters in AI

  • Spam filtering: Naive Bayes classifiers are based on Bayes’ theorem.
  • Recommendation systems: Update preferences based on user actions.
  • Bayesian neural networks: Capture uncertainty in predictions.
  • Medical diagnosis AI: Compute disease probabilities given symptoms.

Intuition for Beginners

Think of Bayes as a way to correct your initial guess (prior) with new data (likelihood) to get a better guess (posterior). It’s like updating your opinion when you get fresh evidence.
